In the real world, processes evolve continuously: physiological signals, financial markets, industrial sensors, or meteorological data are generated at irregular time intervals. However, most machine learning models treat time series as discrete sequences, losing valuable information about the underlying dynamics. Neural Controlled Differential Equations (NCDEs) offer an elegant solution by modeling the evolution of the hidden state through a vector field parameterized by a neural network, driven by the continuous input trajectory. This flexibility allows handling irregularly sampled data and provides maximum expressiveness, but at the cost of high computational expense and a sequential process that limits scalability.

On the other hand, Linear NCDEs replace the nonlinear vector field with a linear one, allowing closed-form solutions and parallel computation over time while maintaining theoretical expressiveness. Furthermore, Structured Linear NCDEs use structured linear vector fields to further optimize efficiency. These developments can reduce training time per step by up to three orders of magnitude, achieving state-of-the-art performance on various time series benchmarks.
